LLM Application Costs: Reduce Waste Without Damaging Answer Quality

Control LLM cost and response time by measuring useful task completion, context size and retries instead of optimizing token prices in isolation.

Define the unit of value

Cost per request can mislead when one request resolves a task and another triggers repeated corrections. Choose a business unit such as an approved document summary or a successfully routed inquiry. Track cost alongside quality and completion time.

A low-cost model is not automatically the least expensive workflow. It may require longer prompts, more calls or more human review. Conversely, a more capable model may be unnecessary for a narrow classification task.

Inspect the whole request path

Record retrieval time, model latency, tool time and retries separately. Remove irrelevant context and duplicated instructions before changing vendors. Consider caching only when the answer can safely be reused, including identity, permissions and source-version checks.

Streaming can improve perceived responsiveness but does not remove backend bottlenecks. A slow database query or excessive tool loop still needs engineering attention.

Change one constraint at a time

Compare context limits, routing rules and model choices against the same evaluation set. Keep quality gates for important edge cases. AWS’s cost-optimization framework provides broader operational context; the workload-specific decision still depends on your own measurements. Do not buy long-term capacity around an untested assumption about demand.

A practical next step

  • Measure cost per acceptable completed task.
  • Identify expensive retries and irrelevant context.
  • Benchmark routing choices against a fixed test set.
  • Review permissions before caching personalized output.
